HierINRSeg - hierarchical multi-layer INR aggregation for parameter-efficient semantic segmentation; INR advantages concentrate in low-parameter and limited-augmentation regimes, so aggregate complementary semantic structure distributed across INR layers instead of scaling parameters. Use for segmentation under memory budgets, cross-site domain shift, or analyzing when INRs beat CNNs.

# HierINRSeg: Cross-Domain Parameter-Efficient INR-Based Semantic Segmentation

## Problem: When Do INRs Actually Win?
Implicit Neural Representations (INRs) are a lightweight alternative for semantic segmentation, but their mechanisms, scaling behavior, and domain generalization were poorly characterized — practitioners lack model-selection guidance for INR vs. U-Net.
## Key Empirical Findings (brain MRI cross-domain)
1. **INR advantage is regime-dependent, not universal**: INR-based models do **not simply improve with parameter budget**. Their edge is most pronounced under **low-parameter budgets and limited augmentation**; U-Nets benefit more from larger capacity + standard augmentation.
2. **Semantic structure is distributed across INR layers**: probing hidden features shows **complementary** segmentation-relevant structure spread over multiple layers — no single layer holds everything.
3. **Cross-domain**: INR robustness advantages show up clearly in out-of-distribution settings.
## Core Mechanism: Hierarchical Multi-Layer Aggregation
Building on finding 2, **HierINRSeg** aggregates representations across INR layers hierarchically instead of relying on the last layer:
- Multi-level feature fusion (U-Net-like skip connections conceptually, but over the *depth of a single INR's* hidden states)
- Result: +5.6 pp Dice in-domain, **+8.2 pp Dice out-of-domain** over MetaSeg (strong recent INR segmentation baseline)
## Recipe
1. Encode the volume with a coordinate-conditioned INR backbone (SIREN-style activations).
2. Collect hidden features at multiple depths (early layers: low-frequency structure; later layers: semantic detail).
3. Hierarchically aggregate: bottom-up fusion with learned weighting per level.
4. Decode segmentation from the aggregated representation.
5. Keep the total parameter budget small — that is where the INR advantage lives.
## Model-Selection Guidance (reusable decision table)
| Condition | Prefer |
|---|---|
| Tight parameter/memory budget, weak augmentation pipeline | INR-based (+ hierarchical aggregation) |
| Large capacity available + standard augmentation feasible | U-Net family |
| Cross-site / distribution-shift deployment | INR with multi-layer aggregation (OOD robustness edge) |
| Plenty of labels, compute, in-domain only | Conventional pipelines |
## Reusable Methodology Notes
- **Regime mapping before architecture advocacy**: characterize where a lightweight alternative wins (parameter budget × augmentation strength × distribution shift) rather than claiming blanket superiority.
- **Layer-distributed semantics → multi-layer aggregation**: when probing shows complementary information across depth, aggregation beats last-layer-only extraction. Same logic as feature-pyramid nets but applies *inside* coordinate networks.
**Activation**: INR segmentation, parameter-efficient medical imaging, hierarchical INR, cross-domain Dice, MetaSeg baseline, low-parameter regime analysis.
